Intelligent Document Processing (IDP) That Extracts Structured Data Reliably

Inside FalconicLab's Intelligent Document Processing (IDP) Engine (exp-03): how we achieve 97.8% extraction precision at $0.05 per run on complex multi-page PDF invoices, tax filings, and legal contracts.

“97.8% PRECISION — Intelligent Document Processing (IDP) Engine (exp-03): Extracting structured JSON schema from complex multi-page PDF invoices, tax filings, and legal contracts. $0.05 per run.” — FalconicLab Experiments (exp-03)

Every enterprise runs on unstructured documents—and almost every enterprise is drowning in broken OCR pipelines.

Walk into the back office of any major institution in Banking & Financial Services, Healthcare & Life Sciences, Insurance & InsurTech, or Logistics & Supply Chain, and you will find millions of multi-page PDFs: commercial invoices with nested multi-currency tables, scanned IRS tax filings, bills of lading with skewed stamps and handwritten quantity corrections, prior-authorization clinical packets, and 80-page master service agreements.

For a decade, enterprises tried to automate these documents with two brittle approaches:

  1. Zonal OCR & Regex Templates: Works only until a vendor shifts a table column 4 millimeters to the right or adds a new line item, breaking the template and requiring weeks of manual rule maintenance.
  2. Naive Text-Dump-to-LLM Pipelines: Running pypdf or basic Tesseract OCR to flatten a PDF into a 1D string and asking a frontier LLM to "extract the JSON" fails catastrophically on complex tables. Flattening a 2D visual grid into a 1D stream destroys spatial column-header alignment, merges multi-line cells across adjacent rows, and loses checkbox states entirely.

At FalconicLab, we engineered Node_ID // exp-03: Intelligent Document Processing (IDP) Engine (FalconicLab Experiments)—a multi-stage Vision-Language and geometric layout pipeline that extracts strictly validated JSON schemas from complex multi-page PDFs at 97.8% precision and an average unit cost of $0.05 per run, driving 80% faster document processing in Government & Public Sector and 70% faster claim settlement in Insurance & InsurTech.

This deep dive walks engineering leaders and ML practitioners through the complete architecture of exp-03, combining OpenCV geometric normalization, LayoutLMv3, Donut, Vision-Language Transformers, grammar-constrained JSON decoding, and deterministic cross-field mathematical verification.

Executive Summary: Why 1D Text Extraction Fails on 2D Enterprise Documents

For CTOs, Operations VPs, and Data Engineering Leaders, the economics of IDP depend on Straight-Through Processing (STP) Precision—the percentage of documents that pass all deterministic validation invariants without requiring a human clerk to re-key the data.

IDP Pipeline Architecture Complex Table & Multi-Page Precision Handwritten & Checkbox Accuracy Mean Cost per 10-Page Document P95 Latency Primary Failure Mode

The 5-Stage Architecture of exp-03

To achieve 97.8% precision at $0.05/run (FalconicLab Skills), exp-03 never feeds raw, uncalibrated PDFs directly into a giant multimodal prompt. Instead, it processes documents through a 5-Stage Deterministic + Neural Pipeline:

Intelligent document processing engine pipeline

Stage 1: OpenCV Geometric Pre-Processing & Hybrid Raster/Vector Routing

Real-world scans arrive rotated at $3.5^{\circ}$, photographed under uneven smartphone lighting, or faxed at 150 DPI with salt-and-pepper noise. If you feed a $4^{\circ}$ skewed table directly into an OCR engine or Vision Transformer, horizontal scanlines cut across adjacent table rows!

Stage 1 executes fast C++ OpenCV operations before any neural model runs:

  1. Radon / Hough Transform Deskewing: Detects dominant horizontal text baselines and rotates the page canvas to $0.0^{\circ}$ alignment within $\pm 0.05^{\circ}$.
  2. Adaptive Sauvola Binarization & Contrast Normalization: Removes coffee stains, background watermarks, and crease shadows while preserving faint handwritten ink and checkbox ticks.
  3. Hybrid Vector/Raster Inspection: If a PDF page contains embedded vector text streams, we extract exact glyph coordinates directly from the PDF instruction stream and verify that no invisible/white-on-white adversarial text layers exist (integrating our exp-04 security check).

Stage 2: 2D Spatial Layout Segmentation with LayoutLMv3

Instead of treating a page as a flat sequence of words, Stage 2 runs a spatial document layout detector based on LayoutLMv3 (Microsoft LayoutLMv3) that jointly models text tokens, 2D bounding-box coordinates $(x_0, y_0, x_1, y_1) \in [0, 1000]^4$, and visual image patches.

Stage 2 partitions every page into typed semantic regions:

  • KV_HEADER_BLOCK (Invoice number, tax ID, issue date, counterparty addresses)
  • STRUCTURED_TABLE_GRID (Line items, financial schedules, lab panel results)
  • CHECKBOX_AND_FORM_CONTROLS (Yes/No radio selections, regulatory attestations)
  • SIGNATURE_AND_STAMP_ENCLAVE (Handwritten signatures, notary seals, dates)

Why Region Cropping Cuts Cost by 85%: Instead of sending an entire 2400x3200 pixel page image into a high-resolution Vision-Language Model when only a 600x400 table needs visual grid reasoning, exp-03 crops only the STRUCTURED_TABLE_GRID and SIGNATURE_AND_STAMP_ENCLAVE regions for high-res VLM inference while processing clean text blocks via lightweight spatial token encoders. This is how we keep average run cost at $0.05 (FalconicLab Experiments).

Stage 3: Cross-Page Table Stitching & Grammar-Constrained Decoding

In enterprise tax filings and commercial invoices, a single table frequently spans 6 consecutive pages—where Page 1 has the column headers (Item Code | Description | Qty | Unit Price | Discount | Net Total), Pages 2–5 have 45 rows each without repeated column headers, and Page 6 has the subtotals.

When naive page-by-page IDP pipelines process Page 3 in isolation, the model guesses which numeric column is Unit Price vs. Discount vs. Net Total, swapping columns 18% of the time.

The exp-03 Cross-Page Table State Machine:

  • When Stage 2 detects an open table at the bottom boundary of Page $p$ ($y_1 > 880$) and a continuation grid at the top of Page $p+1$ ($y_0 < 150$), the orchestrator injects the Locked Column Header Schema & X-Axis Coordinate Anchors from Page 1 directly into the extraction prompt for Pages $2 \dots N$.
  • Every numeric cell on Page $p+1$ is aligned against the normalized horizontal $[x_0, x_1]$ column bands established on Page 1.
  • At the token generation layer, output is constrained by a compiled finite-state grammar matching the target Pydantic JSON Schema—guaranteeing 100.0% valid JSON syntax with zero missing required keys.

Stage 4: Deterministic Mathematical & Domain Invariant Verification

Language models—even vision-language models—predict tokens probabilistically; they do not execute floating-point arithmetic reliably across 150 line items.

In exp-03, no extracted financial, tax, or clinical document is marked VERIFIED until it passes Stage 4’s Deterministic Constraint Solver:

  1. Horizontal Row Invariant: For every row $i$, verify $\text{round}(\text{qty}_i \times \text{unit_price}_i - \text{discount}_i, 2) == \text{line_total}_i$.
  2. Vertical Column Invariant: Verify $\sum_{i=1}^{N} \text{line_total}_i == \text{subtotal}$ and $\text{subtotal} + \text{tax} + \text{shipping} == \text{grand_total}$.
  3. Targeted Zoom Re-Extraction on Mismatch: If Row 14 fails the horizontal math invariant (for example, OCR read a smudged 8 as a 3 in unit_price), the orchestrator does not re-run the entire 10-page document. It uses Row 14’s bounding box [page=2, x0=410, y0=620, x1=890, y1=655] to crop a 2x super-resolution image of Row 14 alone and invokes a targeted verification pass showing the exact mathematical discrepancy!

Real Production Failure Logs from exp-03

At FalconicLab, we publish the exact failure modes we encountered while engineering exp-03 to 97.8% precision across 3,890+ benchmarked multi-page runs (FalconicLab Experiments).

Failure Log #01: IEEE-754 Floating-Point Drift on 200-Row Tax Schedules

[FALCONIC_TELEMETRY // EXP_03_AUDIT_2026_01_18]
node_id: "exp-03 // IDP Engine v2.1"
document_type: "multi_page_commercial_customs_manifest"
false_positive_rejection_rate: "6.4% of valid documents flagged for math mismatch"
root_cause: "PYTHON_FLOAT64_BINARY_ROUNDING_ERROR_IN_VALIDATOR"
  • What Happened: In exp-03 v2.1, our post-extraction validator parsed JSON currency numbers into standard 64-bit IEEE-754 floats (float). On customs manifests with 180+ line items, binary floating-point representation errors (0.1 + 0.2 == 0.30000000000000004) accumulated a $0.01 discrepancy against the printed total on 6.4% of completely valid documents, triggering unnecessary re-read loops.
  • The Architectural Fix: We banned float across all financial and IDP schemas in favor of base-10 decimal.Decimal with explicit ROUND_HALF_UP quantization matching accounting ledger rules. False-positive math rejections dropped to 0.0%.

Failure Log #02: Multi-Column Legal Contract Reading-Order Scrambling

[FALCONIC_TELEMETRY // EXP_03_AUDIT_2026_04_09]
node_id: "exp-03 // IDP Engine v2.4"
document_type: "two_column_commercial_lease_agreement"
error_signature: "INDEMNITY_CLAUSE_MERGED_WITH_ADJACENT_COLUMN_DEFINITIONS"
root_cause: "NAIVE_TOP_TO_BOTTOM_Y_COORDINATE_SORTING_ACROSS_COLUMNS"
  • What Happened: On two-column legal contracts and medical journal attachments, standard OCR sorts words by $(y_0, x_0)$. This caused the extractor to read Line 1 of the left column followed immediately by Line 1 of the right column, scrambling sentences across the center gutter.
  • The Architectural Fix: We implemented XY-Cut Recursive Spatial Tree Ordering combined with LayoutLMv3 reading-order pointers. The layout parser detects vertical whitespace gutters first, segments the page into left and right column containers, and sorts tokens top-to-bottom within each column container before moving to the next column.

6 Engineering Rules for Production-Grade IDP

  1. Never Flatten 2D Documents Into 1D Strings Before Layout Analysis: Always preserve normalized 2D bounding boxes [page, x0, y0, x1, y1] so table columns and multi-column reading order remain intact.
  2. Pre-Process Scans Deterministically in OpenCV: Deskew rotated pages and normalize contrast in C++ (<180ms) before invoking vision transformers.
  3. Crop Regions Instead of Passing Full Pages to Heavy VLMs: Route clean text blocks to fast spatial encoders (LayoutLMv3 / Donut) and reserve high-resolution VLM tokens strictly for cropped table grids and handwritten regions.
  4. Propagate Locked Column Headers Across Multi-Page Tables: Pass Page 1’s column names and X-axis coordinate bands into the extraction state of Pages $2 \dots N$.
  5. Validate Every Extraction with Base-10 Decimal Math: Run horizontal row checks and vertical subtotal invariants using Decimal. Trigger cropped super-resolution re-reads only on the specific bounding box that failed math verification.
  6. Attach Bounding-Box Provenance to Every JSON Field: Emit exact [page, x0, y0, x1, y1] coordinates alongside every extracted value so downstream RAG citations and human reviewers can verify the source in one click.
